Double-deep-Q-learning-Space-Invaders 👾

Agent is trained on Google Colaboratory. Serveral problems have arosed using this platform:

Memory limitation: Google Colab provides 12 GB of RAM memory, but that is not enough to store 1000000 (s,a,r,s',d) tuples (which is around 58 GB of memory if you resize frames to (84,84) and use uint8 to store them as grayscale) in replay buffer. So I came up with an idea to binarize the frames so that I can use 1 bit (instead of 8) to store one pixel. As there is no data type in Python that is represented with 1 bit, I have packed them using numpy.packbits. This allows me to store 300000 tuples in the replay buffer, that uses about 9 GB of RAM (with 2 very big convolutional networks).

Random session termination: Google Colab randomly terminates session if you are using GPU, because it is not made for long-running computations. To get around this problem, I have been periodically saving replay buffer and network weights on the Google Drive. Saving such a large amount of data eats a lot of RAM memory (2-3 GB).

PREPROCESSING

As I have already mentioned frames are binarized and resized to (84,84). In order to capture the speed of the laser beams and the speed of aliens 4 consecutive frames are stacked up to form a state. Throwing the first frame and adding the new frame new state is formed. Random frame skipping is already implemented in the SpaceInvaders-v0 environment.

NETWORK ARCHITECTURE

Target network and online network are identical. Same architecture is used as in original paper network

ACTION SELECTION AND TARGET ESTIMATION

Action is selected using Epsilon-Greedy policy. With epsilon probability the action is selected randomly, otherwise action is selected as a = argmax(Q(s,a')) where Q is the online network. To avoid non-stationary targets (target for the same input changes over time, because agent starts to know things better) and to remove maximization bias (which appears as a consequence of always taking the best action, the network becomes biased towards better actions at the time) the target network is used for estimation of the targets:
target = reward + gamma * max(Q'(s_next,a)), if the state is not terminal
target = reward, otherwise
where gamma is discount factor and Q' is the target network.

LOSS

When the batch is randomly sampled from the replay buffer (this breaks the correlations between the samples) the loss is calculated as the mean squared error, where error is clipped to [-1,1]. Clipping is done to avoid exploding gradients for the large errors. This is called Huber loss, because clipping the error is equivalent to using mean absolute error for errors larger than 1 and smaller than -1. Online network is updated every 4 frames, and target network is updated every 10000 weight updates (W' = W, where W' are the weights of the target network and W are the weights of the online network).

SCORE

Every 100th episode agent is run for 30 episodes with Epsilon-Greedy policy (epsilon = 0.05). Each point in the plot represents the average score on those 30 episodes.
